4 math concepts you need to understand LLMs in 10 minutes.

I spent 6 months confused by AI papers.
Then I found this breakdown by Giles Thomas.
Everything clicked.

Here's the cheat sheet:

1️⃣ Vectors = Direction + Distance in Space

Think GPS coordinates, but in 50,000 dimensions.
Each position represents a different meaning.
"Cat" lives near "dog" in this space.
"Airplane" lives far away.

That's it. That's embeddings.

2️⃣ Matrices = Space Transformers

Remember rotating shapes in geometry class?
Same thing, but with meaning.

A matrix takes your 50,257-dimensional vocab
Projects it down to 768 dimensions
Then back up again.

It's compression without losing the important stuff.

3️⃣ Dot Product = Similarity Score

Multiply matching positions. Add them up.
Big number = similar vectors.
Small number = different vectors.

This is how LLMs know "king - man + woman = queen"

4️⃣ Neural Network Layers = Just Matrix Math

Remove the activation function and what's left?
Matrix multiplication.
A projection from one space to another.

Add activation back = now it can learn patterns.

The GPT-2 Example That Makes It Real:

Input: "The cat sat on the"
1. Convert each word to a one-hot vector (50,257 dimensions)
2. Project down to embeddings (768 dimensions)  
3. Let attention mechanism figure out relationships
4. Project back up to vocab space
5. Pick highest probability: "mat"

That's literally how ChatGPT works.
Just bigger.

Why This Matters:

Everyone's scared of AI math.
But it's high school algebra in a trench coat.

Kimi K2: Just made DeepSeek bigger

The brutal reality:

• No new architectures since "Attention is All You Need" (2017)
• Every innovation = efficiency hack
• We're polishing, not inventing

671 billion parameters.

While everyone's chasing parameter counts, Sebastian mapped the actual mutations:
• MoE: Use 37B of your 671B parameters

Ilya Sutskever says you only need 27 to understand 90% of what matters.

I just went through his list. Here's what shocked me:

What's NOT on the list:
❌ No RAG papers (everyone's obsessed with retrieval)
❌ No prompt engineering papers (despite the hype)
❌ No LangChain or agent frameworks
❌ Nothing about fine-tuning optimization
❌ Zero papers on "emergent abilities"

What IS on the list:
✅ "Attention is All You Need" (obviously)
✅ "The Unreasonable Effectiveness of RNNs" (2015, still matters)
✅ "Scaling Laws for Neural Language Models" (this is the one)
✅ "Kolmogorov Complexity and Algorithmic Randomness" (wait, what?)

The pattern I noticed:

1️⃣ Ilya's not telling you to read papers about using AI.
He's telling you to read papers about how intelligence works.
Three categories dominate his list:
Fundamentals (the architecture breakthroughs)
Attention mechanisms
Residual connections
LSTMs and sequence modeling

Pipeline parallelism

Here's the controversial take:
If you're only reading papers from 2023-2024, you're studying tactics.

Ilya's list is strategy:

"Attention is All You Need" is from 2017.
"Understanding LSTM Networks" is from 2015.
"Deep Residual Learning" is from 2015.
The foundations haven't changed.
We're just scaling them.

The most surprising paper on the list:

"The First Law of Complexodynamics"
It's not even about neural networks.
It's about how complex systems evolve.

This is what separates engineers who use AI from engineers who understand AI.

If you only read 5:

1) Attention is All You Need (transformers)
2) Scaling Laws for Neural Language Models (why GPT works)

Your Twitter feed is pure pain.
"Just deployed my 5th AI startup this week!"
Meanwhile, you can't get embeddings to work.

Level 3: The Clarity Moment
You realize 90% of "AI Engineers" are just prompt engineers.
Most production AI is boring Python scripts.
The magic isn't in the model - it's in the problem.

Here's what got me through the valley:

1️⃣ Ship broken things
My first production model had 67% accuracy.
Still saved the company $200K/year.
Perfect is the enemy of deployed.

2️⃣ Join a startup, not FAANG
Startups let you touch everything.
Break things. Learn fast. Ship faster.
Big tech will teach you one tiny slice.

3️⃣ Build boring solutions
Stop chasing cutting-edge.
Most businesses need basic classification.
Not your 12-layer transformer architecture.

4️⃣ Document everything
Future you will thank present you.
Especially when debugging at 3 AM.
"Why did I set embedding_dim=7?"

5️⃣ Find your valley friends
The loneliest part is thinking you're alone.
You're not. We all went through this.
Some of us just hide it better.

The uncomfortable truth:

The valley of almost useful is necessary.
It's where you learn that AI isn't magic.
It's engineering.

And engineering is mostly debugging.
And crying.
But mostly debugging.

Still in the valley?
Good. That's where real engineers are made.

No abstractions. No "just use torch.nn.MultiHeadAttention."

This is 's breakdown of how LLMs actually work.

Step 1️⃣ Basic self-attention (no weights) 
Shows you the raw math: how a model decides which words matter.
You see why "bank" in "river bank" gets different attention than "bank" in "savings bank."

Step 2️⃣ Add learnable parameters 
Now the model can learn what to pay attention to.
This is where it stops being a simple lookup and becomes intelligence.

Step 3️⃣ Causal masking 
The trick that makes GPT work: tokens can only attend to previous tokens.
Without this, the model cheats during training.

Step 4️⃣ Multi-head attention 
The breakthrough: run 8 attention mechanisms in parallel.
One head learns syntax. Another learns semantics. Another learns long-range dependencies.
This is why transformers work.

👉 What makes this different:

Most tutorials either:
Show you the math (incomprehensible)
Show you the PyTorch API (you learn nothing)

Sebastian does both.

You see the math implemented in code, step by step.

By the end, you understand why attention_weights = softmax(Q @ K.T / sqrt(d_k)) isn't magic.

It's just weighted averaging with learnable weights.

Attention isn't complicated.
It's just "which words should influence this word's representation?"
Then you do that for every word.
Then you stack it 96 times (GPT-4).

One is a pipeline. The other is a feedback loop.

I just built this Agentic RAG system with LangGraph + Milvus

It knows when it's wrong, and fixes itself

Here’s how:

Router: "Can I answer without retrieval?" 
✅ Yes: Skip to generation 
❌ No: Retrieve from Milvus

Grader: "Are these chunks actually relevant?" 
✅ Good: Generate answer 
❌ Bad: Rewrite query, loop back

Validator: "Does this answer match the sources?" 
 ✅ Yes: Return to user 
❌ No: Retry with different approach

It's a graph with feedback loops, not a one-shot pipeline.

The difference:
Traditional RAG commits to one path. No second chances.
Agentic RAG loops back, validates, catches mistakes, and retries until it's right.

Hi, I’m Fabian 👋

3 years ago I came fresh out of a 12-week data science bootcamp and was totally hooked on everything related to data

I wanted to learn every single concept, do every course and finally become the data semigod!



Looking back, this was a very romantic view (some would call it naive)

With every new task and project in my first job, my learning process slowly stagnated

And all of a sudden, without me noticing, it came to a complete hault

- I had little free time to learn new things
- With so many new tools and technologies emerging all the time, I simply didn’t know where to start and where to stop
- Even if I found the time to learn new stuff, I had no idea how to apply it to my job tasks to make it really stick
--> often enough I simply forgot the new stuff after some weeks
- Since most topics went beyond basic stuff and became much more complex than what I did in bootcamp it became quite intimidating to actually start to learn these things
- And finally with demanding workloads and tight deadlines, I completely lost sight of the long-term benefits of learning

Once I realized this, I fell into the rabbit hole of productivity, time-management, self-organization, habits and especially the concept of lifelong-learning

3 years forward - I never came out

I developed learning systems, which enabled me to learn the most important things in each situation as fast, focused and sustainable as possible for me - all while staying in balance with my energy and my actual work task.



All of this enabled me to learn and do nearly everything in the data value chain on my own without having a clear guidebook, which told me what to do or what is important

My name at FUNKE became associated with data and I became the go-to-expert for all data-related questions and projects

I am no expert on any particular data topic and I may not know what will be important in the upcoming years, but with my learning systems and attitude towards lifelong-learning I am more than well prepared to learn any topic & skill I stick my head into.

Your data viz tool is not your data warehouse.
Stop asking it to be.


If you let your data viz tool do heavy data operations
❌ It will consume all your memory
❌ It will be slow
❌ It will fail

✅ Let your data warehouse do the heayy lifting
✅ Then load these tables separately
✅ Model relationships in the tool

PS: The DWH is also a great place to define your KPIs and metrics, so that you have a one central definition instead of 100+ in different dashboards

Confession time.
I used to look down on these "weird people in data"


I studied economics and planned to be a "successful business man."
People working on data systems were just introverted weirdos to me.
But I quickly realized that a business career left me completely unfulfilled.

It drained my energy and I noticed that I simply played a role.
For me it was just too much talking and less doing.
And I felt no purpose in what I was doing.

At that time I had some touchpoints with coding and really enjoyed it.
Meanwhile the first coding bootcamps popped up in Germany.
So I quit my "safe" business career and enrolled in a Data Science bootcamp. 

And for the first time in my life everything clicked for me.
Logic, structure and just building stuff.
Data felt like coming home.

Turns out I'm one those weirdos after all.
And I f*cking love it! 😊

For years, I was convinced I was broken.
Then I learned that I'm a Highly Sensitive Person.
 

Nearly my whole life everything felt just … too much.
I often heard sentences like “don’t be so sensitive” or “just get over it”.
Why did I get so overwhelmed by things no one else seemed to notice?

I felt something was wrong with me, until I read a book about highly sensitive persons.
For the first time in my life I felt really understood.
And I realized that I’m not alone with this.

Sensitivity is not a choice or a feeling.
It’s a neurological trait.
It means my nervous system processes the world more deeply and thoroughly than average.
➡️ I don't just hear noise, my brain absorbs it.
➡️ I don't just see a problem, I process every single potential angle
➡️ I'm an "empathic sponge", I literally feel tension between humans

In a data career, this is a daily battle.
A battle between pragmatism and perfectionism.
A battle between communication and overstimulation


But I learned that it can also be a hidden superpower:
✅ I don't just fix a bug, I find the systemic flaw in the source data that caused it.
✅ I can feel and process the user's frustration, so I'm driven to build solutions that actually solve their pain, not just the technical ticket.
✅ Since chaos is physically draining to me, I naturally build a clean, organized, and well-documented infrastructure

I stopped fighting my wiring.
Now I use it as a tool to build awesome stuff!

Most data teams fail
Because they act like "service providers"


❌ Being a service provider team
- Business asks "build me a sales dashboard with metric A, B and C!"
- Data team says "okay"
- Dashboard is built but doesn't generate insights for business
- Business complains "we tried data but it doesn't actually help to drive sales"

✅ Instead they can be a business translator team
- Business asks "build me a sales dashboard with metric A, B and C!"
- Data team asks "Why?"
- Data team finds out that business needs a breakdown by region and product, because sales dropped and no one knows why
- Business takes action upon the new information and will come back with new questions


Service provider teams are order-takers.
Business translator teams are problem-solvers.
Most of the time only problem-solving generates value.

I was thinking all wrong about spreadsheets.
Excel and Sheets are my most valuable connectors to the business.

Tech teams often see spreadsheets as a dirty data source.
Business teams see spreadsheets as the only data source.
In reality it is a powerful bridge.

Here are 2 ways to use it as a serious data tool:

1️⃣ Mapping (my favourite use case):
Mappings (e.g. product id to product category) are often dynamic and can change quite a lot.
So instead of keeping this logic buried in your code, keep it in a spreadsheet and ingest it directly into your pipelines.
That way you and your stakeholders can keep the mappings up to date and all changes are directly taken to your workflows.

2️⃣ Query the DWH / BI-Tool
Enable your business stakeholders to get the data they need and let them do their analysis wherever they feel the most comfortable.
This can be done as a direct connection to the data warehouse or by setting filters in a dashboard and then exporting the resulting data


Stop with the data snobbery about spreadsheets.
And definitely stop seeing Sheets as your sworn enemy.
Start seeing it as your most valuable connector between business and tech.

I learned more about data infrastructure from my backpack than from most online courses

Sounds weird, I know. But hear me out ⬇️


When you travel for a year with just a backpack, you become an expert in minimalism and pragmatism.

You learn quickly that "good enough" is almost always the right answer.

You don't need a lot of stuff, you need gear that is reliable and fulfills a purpose.


Every gram you put into your backpack is literally weighing you down.

So you have to carefully select what to bring, what to keep and what to let go during the trip.

Traveling like this was minimalism in practice, and it was liberating.


When I came back to my job, I realized I brought that exact mindset with me. 

Before the trip, I followed the newest shiny tech and built complex infrastructure

Now I stick to simple basics and always ask myself if this is aligned with the initial problem


Like I packed for my trip, I now follow some basic guidelines for every project

✅ Business first approach
Start with the business question and not with a technical solution
✅ Minimalist by Default
Build ONLY what is necessary in order to answer the business question
✅ Make Smart Sacrifices
Accept initial trade-offs and add missing things over time, if necessary

That way you can closely iterate on the problem and the journey is a bit easier!

And complexity can always be added later on!


While I was away I happily noticed that I share this line of thought also with others like Julien Hurault or Mike Kamysz!
